In this study, a data-driven artificial intelligence (AI) model of the Lorenz system was constructed using a multi-layer perceptron (MLP) neural network, and a four-dimensional variational (4D-Var) data assimilation system was developed using this model. The AI model was trained to predict the state of the Lorenz system at a time interval ten times larger than the integration time interval of the original dynamical model, and it successfully reproduced chaotic characteristics of the Lorenz system, including the attractor structure, deterministic non-periodic flow, bifurcation phenomena, and sensitivity to initial conditions. The tangent linear and adjoint models of the AI model were derived using automatic differentiation, and the accuracy of the adjoint gradients was verified numerically. The AI 4D-Var model showed analysis accuracy comparable to that of the classical 4D-Var model. By combining a NumPy implementation based on extracted model weights (AI-NP) with network reduction, it achieved computational performance up to approximately 3.5 times faster than that of the classical 4D-Var model. With an appropriately sized network, a residual-learning method that adds a neural-network correction to the physics-based Euler forward-difference scheme also showed accuracy comparable to that of the classical 4D-Var model. In ensemble experiments comprising 64 cases, which combined eight initial conditions extracted from the Lorenz attractor with eight background-perturbation magnitudes, performance generally improved as network size increased. In particular, the AI-NP model with hidden-layer size h = 64 achieved a mean analysis error of 1.18 and a success rate of 90.6%, showing performance comparable to that of the classical 4D-Var model, which achieved a mean analysis error of 1.52 and a success rate of 87.5%. These results suggest that an AI-based 4D-Var model with sufficient network capacity can perform comparably to the classical 4D-Var model in a low-dimensional chaotic system. This study is a proof of concept in a low-dimensional chaotic system; future work should extend the validation to partial-observation settings and more complex systems.
본 연구에서는 다층 퍼셉트론(multi-layer perceptron, MLP) 신경망을 이용하여 Lorenz 시스템의 자료기반 인공지능(artificial intelligence, AI) 모델을 구축하고, 이를 활용한 4차원 변분(four-dimensional variational, 4D-Var) 자료동화 시스템을 개발하였다. AI 모델은 기존 역학 모델의 적분 시간 간격보다 10배 큰 시간 간격에서 Lorenz 시스템의 상태를 예측하도록 학습되었으며, 끌개 구조, 결정론적 불규칙 흐름, 분기 현상 및 초기 조건 민감성 등 카오스적 특성을 잘 재현하였다. 자동미분을 적용하여 AI 모델의 접선형 모델과 수반 모델을 도출하고, 수반 기울기의 정확성을 수치적으로 검증하였다. AI 4D-Var 모델은 전통적 4D-Var 모델과 유사한 분석 정확도를 보였고, 모델 가중치를 추출한 NumPy 구현(AI-NP)과 네트워크 축소를 결합하여 전통적 4D-Var 모델 대비 최대 약 3.5배 빠른 계산 성능을 달성하였다. 물리 기반 Euler 전진 차분에 신경망 보정을 추가한 잔차 학습 기법도 적절한 네트워크 규모에서 전통적 4D-Var 모델과 유사한 정확도를 나타냈다. Lorenz 끌개에서 추출한 8개의 초기 조건과 8가지 배경장 섭동 크기를 조합한 64개 케이스의 앙상블 실험에서는 네트워크가 클수록 성능이 대체로 향상되었다. 특히 은닉층 크기 h = 64인 AI-NP 실험은 평균 분석 오차 1.18과 성공률 90.6%를 기록하여, 평균 분석 오차 1.52와 성공률 87.5%를 기록한 전통적 4D-Var 모델과 비교 가능한 성능을 보였다. 이러한 결과는 충분한 네트워크 용량을 갖춘 AI 기반 4D-Var 모델이 저차원 카오스 시스템에서 전통적 4D-Var 모델과 동등한 수준의 성능을 보일 수 있음을 시사한다. 본 연구는 저차원 카오스 시스템에서의 개념 검증으로서, 향후 부분 관측 조건과 보다 복잡한 방정식계로의 확장 검증이 필요하다.
